Why are beautifully elegant mathematical theorems more often true than complicated unaesthetic conjectures? Is there a deeper connection between aesthetics and truth?

The natural philosophers who formed the bedrock of modern science were all in agreement that truth and aesthetics were linked.

they’re simpler and/or have more far-reaching consequences
“aesthetics” in math means just that

have you never seen a complicated theorum? or an elegant congecture?
anything is true with a vague claim and cherrypicked evidence

You simply have selective attention or haven't been exposed to enough mathematics. Modular representation theory is full of both beautiful but ultimately wrong conjectures, and disgusting looking theorems which prove those conjectures wrong.

You have it backwards. Of all the probably-true things that exist, we more often pursue the beautiful ones because those are satisfying to confirm.

Depends, some might think dedekind cuts are an ugly abomination others might think it's a beautiful construction.
