What are some things that new touhou fans should know?

Both canon and fanon things.

Whatever you do, don't take it too seriously.
Make up your own impressions of the characters. That's what makes the doujins in the first place.
Play the games, or at least try to. If you have to play easy mode, it's better than not playing at all.

The spell card rules and how they came about.

The Hakurei Border, where Reimu's shrine is, and Yukari's general involvement in its creation.

The major locations of Gensokyo: the village, the forest of magic, the bamboo forest, the misty lake, the youkai mountain, the netherworld, the Sanzu river, etc.

The various youkai types. The tengu, the kappa, the oni, the ghosts, the fairies, etc.

You don't need to know them to play the game. You don't need to know anything besides "hold shift for focused fire" to play the games.

But the entire premise of youkai-cause-incident -> humans-resolve-incident (which is basically what happens in every game) is based on the spellcard rules. If the spellcard rules didn't exist, youkai would indiscriminately kill humans and humans would indiscriminately kill youkai. I can't think of a more crucial fact to understanding Touhou than this.

Touhou is loosely based on japanese and occidental folklore.

That which is not human is a youkai. If they fly, they normally have a silly hat. Removal of said hat causes immediate death.

Also, youkai moe. Touhou is about Youkai Moe.
